Although worldwide penetration of solar power is expected to rapidly increase until 2030, grid integration of solar power may be limited by an intermittent property and poor predictability depending on local weather conditions. The variable and uncertain nature of solar power imposes substantial challenges for PV power producers and independent service operators (ISOs). Especially, this uncertainty problem may cause a negative effect on the economical profit for utility-scale PV power producers because the capacity of energy storage systems (ESSs) needs to be increased to make the PV output power dispatchable. Thus, an accurate solar power prediction scheme is needed to 1) reduce the impact of uncertainty; 2) improve the economical benefit of PV systems; and 3) enhance the system reliability of power grid.
In the demand-side of power grids, load forecasting is an important task for the reliable operation and effective planning of power grids regardless of the load size and the range of the forecasted area. Very short-term and short-term load forecasting, especially ranging from several minutes-ahead to day-ahead, is a key issue for power system security, economic dispatch, and market operation, etc. Nowadays, system-level load forecasting has been well established and achieves high forecasting accuracy due to periodic and stable load patterns. On the other hand, load forecasting of low-level loads (e.g., individual household or a small community) is a more challenging task due to a lack of low-level data and complexity of load consumption behaviors. With the deployment of a large number of smart meters, more detailed energy usage (e.g., individual appliances: air conditioner, electric vehicle) information has become available. These newly collected information with a finer resolution is critical for improving the load forecasting accuracy and efficiency of energy management and planning in the power grid.
In microgrids, they consist of a group of interconnected loads and distributed energy resources (DERs) as a single controllable entity and can connect or disconnect from the grid to enable it to operate in both of a grid-connected mode or island mode, respectively. Thus, the intelligent control of DERs is critical in realizing a power system which can deal with both the variability and uncertainty of energy supply and demand.
In this dissertation, we propose hourly solar power prediction schemes based on similar weather type clustering and machine learning schemes. We also investigate the error analysis of solar power prediction. It is shown that the solar irradiance prediction errors of each prediction scheme can be categorized to be leptokurtic and a $t$ location-scale distribution is proposed as a distribution fitting for the prediction errors. In addition, we estimate the effect of PV power prediction errors on energy storage system (ESS)-based PV power trading in energy markets. First, an efficient ESS management scheme is proposed for charging and discharging operation of ESS in order to reduce the deviations between the day-ahead (DA) and real-time (RT) dispatch in energy markets. Furthermore, the capacity of ESSs, which can absorb the prediction errors, is estimated from different energy market constraints. And then, we calculate the PV power producer's profit considering the deviation penalties in case of ML-based prediction schemes with/without ESS. As a result, the benefit from the accurate prediction scheme with ESS management is analyzed at a locational marginal price (LMP) market. Furthermore, the economic analysis of ESS installation for using both of the artificial neural network (ANN) and support vector machine (SVM) schemes is done through the benefit cost analysis (BCA).
In addition, in this dissertation, we investigate sub-hourly and day-ahead load forecasting based on the ANN scheme. We use low-level data with a finer resolution. Especially, high power appliances are used as an additional input parameter in order to improve the forecasting accuracy. As a case study, real-world energy consumption data are collected, where the data are provided by a large number of smart meters. And then, we describe the collected data in terms of two key parameters of predictability: aggregation level and data granularity. Using the ANN-based load forecasting scheme, we evaluate the impact of different aggregation levels and prediction time horizons. In addition, we estimate the prediction error distributions of both of a single household and the aggregated loads.
In this dissertation, a model predictive control (MPC) approach is developed to efficiently optimize the microgrid operations. The optimization problem is formulated to minimize the total operation cost under the uncertainty of PV output power and varying load demands for a given time horizon. The optimization problem is also based on high-temporal rate as well as the more commonly used hourly data rate. Especially, the step-wise scheduling of DERs makes large frequency deviations in an islanded microgrid at each dispatch interval. Thus, the accuracy of different temporal resolution data on the optimal power dispatch is quantitatively evaluated in terms of the following performance metrics: 1) the degree of the frequency deviation; and 2) The size of the ESS as a regulating capacity. We evaluate the performance through simulations using real-data that demonstrate the ability of the optimization framework in order to consider the system reliability as well as the economic aspects for different temporal resolution data.
세계적으로 태양광 발전의 보급률이 빠르게 증가될 것으로 예상되지만 태양광 발전의 전력망 연계는 지역적인 날씨 상태 변동에 따른 간헐성과 낮은 예측 정확도로 인해 여전히 많은 어려움을 겪고 있다. 변동성과 불확실성이 높은 태양광 발전의 속성은 태양광 발전 사업자와 ISO (Independent Service Operator)에게 지속적인 어려움을 부과한다. 특히, 불확실성 문제는 에너지 저장 장치의 설비 용량을 증가로 이어져 대규모의 태양광 발전 사업자의 경제적 이익에 부정적인 영향을 미친다.
전력망의 전력의 수요 측면에서 전력부하의 예측은 전력망의 안정적인 동작과 효율적인 계획 수립을 위해서 매우 중요한 역할을 한다. 특히, 수 분 이후에서 하루 이후를 예측하는 극단주기와 단주기 전력 수요 예측은 전력 시스템의 안정성, 경제 급전과 시장 운영의 핵심 요소이다. 오늘날 대규모 전력 수요의 예측 기술은 전력 수요의 주기성과 안정적인 형태로 높은 정확도를 보장할 수 있으나 개별 수용가와 소규모 전력 수요의 경우 전력 수요의 복잡한 행동 양식으로 인하여 여전히 많은 도전적인 문제가 남아있다. 최근 많은 수의 스마트 미터가 설치되면서 개별 전기기기의 사용량 정보와 같은 세부적인 에너지 사용 정보의 수집이 가능해졌다. 또한 초근 1분 단위의 높은 시간 분해능의 에너지 소비 데이터가 수집되면서 전력 수요 예측의 정확도와 전력망의 에너지 관리와 계획의 효율성을 높일 것으로 기대된다.
본 학위 논문에서는 날씨 조건에 따른 클러스터링과 머신러닝 기반의 태양광 출력 예측 기법을 제안한다. 또한 본 논문에서는 태양광 발전 예측 오차를 분석하고 해당 오차가 급첨적 (leptokurtic) 특성으로 가지고 $t$ location-scale 분포를 따르는 것을 증명하였다. 더 나아가 본 학위 논문에서는 에너지 저장 장치 기반의 에너지 시장에서 태양광 출력 예측 오차의 영향성을 평가하였다. 우선, 하루 전 계약용량과 실시간 공급용량의 차이를 보상하기 위한 효과적인 에너지 저장 장치의 관리 기법을 제안하였다. 또한 서로 다른 에너지 시장 조건에서 예측 오차를 흡수하기 위한 에너지 저장 장치의 용량은 산정하였다. 그리고 각 머신러닝 기법별 에너지 저장 장치의 유무에 따른 태양광 발전 사업의 이윤을 산출하고 비용 편익 분석을 이용한 각 기계학습 기법별 경제성 분석을 진행하여 에너지 저장 장치 설치의 타당성을 검증하였다.
또한 본 학위 논문에서는 인공지능신경망 기법 기반의 극단주기와 단주기 전력 수요 예측 연구를 진행하였다. 본 학위 논문에서는 높은 시간 분해능의 소규모 전력 수요 데이터를 사용하였다. 특히, 예측의 정확도를 향상 시키기 위해 고전력 전기기기의 사용량을 추가적인 입력변수로 활용하였다. 많은 수의 스마트 미터에서 공급하는 실증단지의 세부적인 데이터를 활용하여 수용가의 합산 (Aggregation) 수준과 데이터의 입자도 (Granularity)에 따른 예측 가능성을 평가하였다. 더 나아가 인공지능신경망 기법 기반으로 서로 다른 합산 (Aggregation) 수준과 예측 주기가 예측 정확도에 미치는 영향을 평가하였다.
마지막으로 본 학위 논문에서는 주어진 운영 환경의 변화를 빠르게 반영할 수 있는 모델 예측 제어 (Model Predictive Control) 기법을 마이크로그리드 에너지 관리 최적화 모델을 세우기 위해 사용하였다. 본 최적화 문제는 주어진 시간 간격 동안 태양광 출력과 전력부하의 변동성에 따른 불확실성을 반영하여 총 운영비용을 최소화 하는 목적함수를 수립하였다. 또한 본 최적화 문제는 기존 마이크로그리드 에너지 관리 최적화 연구들과 비교하여 훨씬 높은 시간 분해능의 데이터를 사용한다. 발전기 운영 계획수립 및 경제급전 문제에서 하나의 시간 간격동안 동일한 전력을 공급하는 계단 형태의 분산 전원 최적 스케쥴링은 매시간 독립모드 마이크로그리드의 큰 주파수 변동 및 불안정성을 야기한다. 그러므로 본 학위 논문에서는 수요와 공급 데이터의 서로 다른 시간 분해능에 따른 최적 스케쥴링의 정확도를 평가하고 실제 전력 수요와의 불일치 정도를 정량적으로 평가하였다. 이러한 불일치에 따른 주파수의 변동성을 평가하고 이를 보상하기 위한 에너지 저장 장치의 예비용량과 추가 지출 비용을 산정했다. 최종적으로 본 연구에서 제안하는 마이크로그리드 최적 에너지 관리 기법은 수요와 공급 데이터의 서로 다른 시간 분해능이 야기하는 경제적인 측면과 안정성 측면을 동시에 확인할 수 있는 연구 결과를 도출하였다.
