The discovery of new functional materials has been continuously demanded in recent decades and has brought significant advancements across various industries. Among various materials, particularly in the energy-related field that has attracted considerable attention in recent years, inorganic materials play a key role and their diverse properties are determined by the crystal structure of the inorganic materials. In the past, predicting the crystal structure of a material with desired properties involved using chemical intuition or making slight modifications to existing material structures. Subsequently, their properties were evaluated experimentally or computationally. However, a more efficient approach is needed to accelerate the discovery of advanced inorganic crystals with desired properties. Recently, with the development of computational science, various databases of inorganic crystal structures have been accumulated, and research on material exploration using these databases, specifically high-throughput virtual screening (HTVS), is actively conducted. At the same time, the advancement of machine learning has led to the proposal of various machine learning methodologies to aid in material exploration, contributing to the acceleration of inorganic material design. In this paper, we propose two deep generative model-based crystal structure prediction models, trained through adversarial learning, to overcome the limitations of previous material exploration research and increase search efficiency. The first model is a crystal structure prediction model based on conditional generative adversarial networks. We overcome the limitations of existing HTVS methods by utilizing this generative model-based HTVS model to create a new Mg-Mn-O polymorph promising as photoanode that does not exist in the existing database. The second model is a domain transformation model based on the pix2pix model. To reduce the significant computational cost associated with density functional theory (DFT) relaxation, which has been considered a major bottleneck in existing HTVS methods, we propose a new data-driven crystal structure relaxation model.
새로운 기능성 물질의 발견은 최근 수십 년 동안 지속적으로 요구되어 왔으며, 다양한 산업에서 엄청난 발전을 가져왔다. 여러 소재들 중, 특히 무기 소재는 최근 들어 큰 관심을 끌고 있는 에너지 관련 분야에서 핵심 소재로 활용되고 있으며, 이러한 무기 소재의 다양한 특성은 소재의 결정 구조에 의해 결정된다. 기존에는 화학적 직관을 사용하거나 기존 물질 구조로부터 약간의 변형을 주어 원하는 특성을 갖는 물질의 결정 구조를 예측하고, 이후 그들의 특성은 실험적으로 또는 계산적으로 평가되어왔다. 하지만 원하는 물성을 갖는 무기 소재 발견의 가속화를 위해 더 효율적인 접근법이 필요하다. 최근에는 전산과학의 발달로 다양한 무기결정 데이터들이 축적되면서 이러한 데이터베이스를 직접 탐색해 신소재를 발굴하는 설계 방식, 즉 고처리량 가상스크리닝(HTVS)을 활용한 소재 탐색 연구가 활발하게 수행되고 있고, 동시에 기계학습의 발전으로 소재 탐색에 다양한 기계학습 방법론들이 제안되어 무기물 설계 가속화에 도움을 주고 있다. 본 논문에서는 기존의 소재 탐색 연구의 한계를 극복하고 탐색 효율을 높이기 위해 적대적 학습으로 학습된 두 가지 심층 생성 모델 기반의 결정 구조 예측 모델들을 제안한다. 첫 번째는 조건부 적대적 생성망을 기반으로 한 결정 구조 예측 모델이다. 우리는 기존 데이터베이스에 존재하지 않는 새로운 유망한 Mg-Mn-O 다형을 생성하기 위해 이 생성모델 기반의 HTVS 모델을 활용하여 기존 HTVS 방법의 한계를 극복하였다. 그리고 두 번째는 pix2pix 모델에 기반한 도메인 변환 모델입니다. 우리는 기존 HTVS 방법에서 주요 병목 현상으로 간주되는 DFT 완화 비용을 줄이기 위해 새로운 데이터 기반의 결정 구조 완화 모델을 제안했다.
