A data-driven predictive model using a deep neural network to efficiently predict the transverse mechanical behavior of fiber-reinforced composites was developed. The training data was obtained through progressive failure analysis, with the microstructure of the composite and stress-strain curves serving as the input and output information, respectively. The influence of input features on the performance of the deep neural network model was analyzed by converting the microstructure image of the composite into various vectorized input features. The predictive performance of the deep neural network model was improved by developing a fiber distribution function based on fiber area and applying it as an input feature. The research was divided into two parts: understanding the mechanical behavior of composites from a micromechanical perspective through testing and computational analysis, and predicting the mechanical behavior of composites through data-driven predictive model development. A high-performance fiber-reinforced composite, which is used in aerospace applications but has limited research results from a micromechanical perspective, was selected as the testing subject. Microscale transverse tensile tests to observe the microstructure, microcracks, and failure of the composite was performed. To enhance the capability of digital image correlation at micro-region, a particle-free speckled pattern was proposed. This pattern enables the virtual measurement of strain occurring in the micro region between fibers. Interpolation of the observed actual fiber shape with a Fourier series and parameterization was employed to generate representative volume element that reflects the actual fiber shape. Progressive failure analysis was conducted using a cohesive zone model, and analytical results that agreed the test results were derived. Through this process, a framework for a computational analysis with high-fidelity based on actual tests was constructed. In current studies, the microstructure of circular fiber composites has been represented by fiber centroid coordinates and used as input features for deep neural networks. In this study, the microstructure of composite materials was represented using various vectorized input features based on image or based on domain-knowledge, and their impact on the performance of the prediction model was analyzed. Furthermore, the transverse mechanical behavior prediction performance of the deep neural network model was improved by developing a new fiber distribution function and applying it. Additionally, the effects of dimensionality reduction techniques and data augmentation in data processing methods were verified.
섬유강화 복합재의 횡방향 기계적 거동을 효율적으로 예측하는 심층신경망을 이용하는 데이터기반 예측모델을 개발하였다. 학습정보는 점진적 파손해석을 수행하여 확보하였으며, 입출력정보는 각각 복합재 미시구조와 응력-변형률 곡선에 해당한다. 복합재 미시구조 영상정보를 벡터형식의 다양한 입력특징으로 변환하여 적용함으로써, 심층신경망 모델의 성능에 대한 입력특징의 영향성을 분석하였다. 섬유면적에 기반한 섬유분포함수를 개발하여 입력특징으로 적용함으로써 심층신경망 모델의 예측성능을 향상시켰다. 연구는 시험과 해석을 통하여 미시역학적 관점에서 복합재의 기계적 거동을 이해하는 부분과 데이터기반 예측모델 개발을 통하여 복합재의 기계적 거동을 예측하는 부분으로 나누어 진행하였다. 우주용 소재로 활용되고 있으나 미시역학적 관점에서 연구결과가 거의 제시되지 않고 있는 높은 취성의 섬유강화 복합재를 시험 대상으로 선정하였다. 마이크로스케일 횡방향 인장시험을 수행하여 복합재 미시구조와 미시균열 및 파손을 관측하였다. 표면 파티클의 분산이 필요없는 방법을 제안하여 디지털영상상관분석 능력을 향상시키고 섬유간 미시영역에서 발생하는 변형률을 비접촉식으로 측정하였다. 관측된 실제 섬유형상을 푸리에급수로 보간하여 매개변수화하여 실제 섬유형상을 반영하는 대표체적요소 생성 시에 활용하는 방안을 제안하였다. 응집영역모델을 이용한 점진적 파손해석을 수행하여 시험결과에 부합하는 해석결과를 도출하였다. 이러한 과정을 통하여 실제 시험에 기반한 고충실 해석기법에 대한 프레임워크를 구축하였다. 기존의 연구에서는 원형 섬유 복합재의 미시구조는 섬유중심좌표로 표현되어 심층신경망의 입력특징으로 활용되어 왔다. 본 연구에서는 복합재 미시구조를 영상기반 또는 지식기반한 다양한 벡터형식의 입력특징으로 표현하고 예측모델의 성능에 미치는 영향성을 분석하였다. 그리고, 새로운 섬유분포함수를 개발하여 적용함으로써 심층신경망모델의 복합재 횡방향 기계적 거동예측 성능을 향상시킬 수 있었다. 추가적으로 차원축소기법 및 데이터 증강의 데이터 처리기법의 효과를 검증하였다.
