Uncertainty on the information essential to decision-making and inconsistencies between different decision levels are the main contributors to interrupt sustainable operation of chemical manufacturing systems. Thus a new discipline is required beyond the existing deterministic and reactive approaches to introduce a globally optimal solution at each time. Therefore, the purpose of this study is to introduce a smart and sustainable management and operation strategy for energy/chemical manufacturing system through data and model based decision supporting tools representing (projecting) an uncertain real world. In particular, the study focuses on the linkage between the high-level (planning) and the low-level (operation) decision layers. The resulting expansion of the boundary of decision-making process can provide more robust and flexible management and operation strategies by resolving inconsistency between different levels.
For this, I develop a multi-scale decision-making model that combines Markov decision process and mathematical programming in a complementary way. To support the integration of the decision hierarchy, a data-driven uncertainty prediction model is suggested which is valid across all time scales considered. To obtain a computationally feasible solution of the proposed model, reinforcement learning is introduced and knowledge necessary for decision-making is learned through optimization-embedded simulation. Specifically, function approximation techniques and Bayesian inference are performed to learn the value function that quantifies the long-term value of the current system state and to statistically improve the beliefs on the incomplete model parameters. The usefulness of the developed multi-scale decision-making model is proven through the following case studies that are motivated by real industrial problems: 1) integrated procurement planning and scheduling considering trade-offs between multiple suppliers and uncertainties in supply and demand, 2) operational planning and optimal sizing of microgrid considering multi-scale uncertainty in wind supply, and 3) crude procurement and refinery operational planning considering variations in crude/product price and randomness in crude quality.
의사결정에 필수적인 정보에 존재하는 높은 수준의 불확실성과 의사결정 계층 간의 불일치는 지속 가능한 운영을 방해하는 주 요인으로서, 이를 해결하기 위해서는 기존의 결정론적, 수동적 접근법을 넘어서는 새로운 접근법이 필요하다. 따라서 본 연구의 목적은 불확실한 현실 세계를 반영(예측)하는 데이터 및 모델 기반 의사 결정 지원 도구를 통해 에너지 및 화학 제조 시스템을 위한 지능적이고 지속 가능한 관리 및 운영 전략을 제시하는 것이다. 특별히 본 연구는 상위 수준(계획 및 관리)과 하위 수준(공장 운영) 결정 계층 간의 연결에 초점을 두어 의사결정 프로세스의 경계를 확장시킴으로써 서로 다른 계층의 불일치를 해결하여 보다 강건하고 유연한 관리 및 운영 전략을 제공 하고자 한다.
이를 위해 마르코프 결정 과정과 수학적 계획법을 상호보완적으로 결합한 계층적 통합 의사결정 모델을 제안한다. 또한, 의사결정 계층의 통합을 지원하기 위해 고려된 모든 시간 스케일에서 일관적으로 유효한 다단계 불확실성 예측 모델이 실제 데이터를 기반으로 개발된다. 이러한 의사결정 모델의 실행가능 솔루션을 얻기 위해 강화학습을 도입하여 최적화가 내장된 시뮬레이션을 통해 의사결정에 필요한 지식을 학습한다. 구체적으로 현재 시스템 상태의 장기적 가치를 정량화하는 가치함수와 불완전한 모델 매개변수의 통계적 개선을 위해 함수 근사 기법, 베이지안 추론이 수행된다. 개발된 다단계 의사결정 모델과 솔루션 알고리즘은 실제 산업 문제에서 벤치마킹 된 3가지 사례 연구를 통해 검증된다: 1) 공급자 간의 트레이드오프와 수요와 공급의 불확실성을 고려한 통합 조달 계획 및 스케줄링 2) 풍력의 다단계 불확실성을 고려한 마이크로그리드의 운영 계획 및 최적 용량 산정, 3) 원유/제품의 가격 변동성과 원유 품질의 무작위성을 고려한 원유 조달 및 정유공장 운영 계획.
